Knowledge Graphs and their limitations

With the rapid growth of AI applications, Knowledge Graphs (KGs) have emerged as a basic structure for representing information in a machine-readable manner. They organize information as triplets—the head entity, the relation, and the tail entity—forming a graph-like structure where entities are the nodes and relationships are the edges. This representation allows machines to understand and reason about connected information, supporting intelligent applications such as question answering, semantic analysis, and recommendation systems.

Despite their effectiveness, Knowledge Graphs (KGs) have significant limitations. They often miss important contextual information, making it difficult to capture the complexity and richness of real-world information. Additionally, many KGs suffer from data overload, where entities and relationships are incomplete or poorly connected. This lack of full annotation reduces the situational cues available during inference, which poses challenges for efficient reasoning, even when combined with large language models.

Content Graphs

Content Graphs (CGs) extend traditional knowledge Graphs by adding additional information such as time, location, and source information. Instead of storing information as isolated facts, they capture the context in which a fact or decision occurs, leading to a clearer and more accurate understanding of real-world information.

When used with agent-based systems, context graphs also store how decisions were made. Agents need more than the rules—they need to know how the rules were applied in the past, when exceptions were allowed, who authorized decisions, and how disputes were handled. Since agents work directly where decisions are made, they can naturally record this full context.

Over time, these stored decisions form a context graph that helps agents learn from past actions. This allows systems to understand not only what happened, but also why it happened, making agent behavior consistent and reliable.

What are the effects of content knowledge?

Content knowledge adds important layers to knowledge representation by going beyond simple facts—relational facts. It helps distinguish between facts that look similar but occur under different circumstances, such as differences in time, place, scale, or circumstances. For example, two companies may compete in one market or period but not in another. By taking such a context, systems can represent information in a more detailed way and avoid handling all facts that look the same.

In context graphs, context information also plays an important role in reasoning and decision making. It includes signals such as historical decisions, policies applied, exceptions granted, authorizations involved, and related events from other systems. When agents record how a decision was made—what data was used, what rule was checked, and why exceptions were allowed—this information becomes reusable context for future decisions. Over time, these records help connect entities that are not directly connected and allow systems to reason based on past and previous results, rather than relying solely on fixed rules or isolated triples.

There has been a clear shift in AI systems—from static tools to decision-making agents, largely driven by major industry players. Real-world decisions are rarely based on rules alone; include exceptions, approvals, and lessons from past situations. Context graphs address this gap by capturing how decisions are made across systems—what policies were evaluated, what data was used, who approved the decision, and what outcome was followed. By organizing this decision history as a context, agents can re-use previous judgments instead of re-reading the same cases. Some examples of this change include:

Google

  • Gmail’s Gemini features and Gemini 3-based agent frameworks both feature AI moving from simple assistance to effective decision-making, whether that’s managing inbox priorities or implementing complex workflows.
  • Gmail relies on conversation history and user intent, while Gemini 3 agents use memory and context to handle long-running tasks. In both cases, context is more important than individual information.
  • Gemini 3 serves as an orchestration layer for multiple agent systems (ADK, Agno, Letta, Eigent), similar to how Gemini organizes summarizing, writing, and prioritizing within Gmail.
  • Features like AI inbox and Suggested Replies rely on continuous understanding of user behavior, just as agent frameworks like Letta and mem0 rely on high-level memory to avoid context loss and ensure consistent behavior.
  • Gmail turns email into actionable summaries and actions, while Gemini-enabled agents automate browsers, workflows, and business tasks—both of which signal a broader shift to active, non-reactive AI systems.

OpenAI

  • ChatGPT Health brings health data from different sources—medical records, apps, wearables, and notes—into one place. This creates a clear, shared context that helps the system understand patterns of health over time instead of answering questions in isolation, similar to how context graphs link facts to their context.
  • Using personal health history and previous interactions, ChatGPT Health helps users make better informed decisions, such as preparing for doctor visits or understanding test results.
  • Life operates in a separate, secure environment, which keeps sensitive information private and contained. This ensures that health context remains accurate and secure, which is essential for the safe use of context-based systems such as context graphs.

JP Morgan

  • JP Morgan replacing proxy advisors with its AI tool, Proxy IQ, reflects a shift to building in-house decision systems that aggregate and analyze voting data from thousands of meetings, rather than relying on third-party recommendations.
  • By analyzing proxy data internally, a firm can combine historical voting behavior, company-specific information, and firm-level policies—with the view of contextual graphs that preserve how decisions are made over time.
  • AI-based internal analytics gives JP Morgan more transparency, speed, and consistency in proxy voting, reflecting a broader move toward AI-driven informed decision-making in corporate settings.

NVIDIA

  • NVIDIA’s NeMo Agent Toolkit helps transform AI agents into production-ready systems by adding visual, experimental, and resource controls. By capturing traces of action, thought steps, and action signals, it records how the agent arrived at an outcome—not just the end result—closer to the concept of context graphs.
  • Tools like OpenTelemetry tracking and structured testing turn agent behavior into actionable context. This makes it easy to debug, compare different runs, and improve reliability incrementally.
  • Similar to how DLSS 4.5 integrates AI deeply into real-time graphics pipelines, NAT integrates AI agents into business workflows. Both highlight the broader shift toward AI systems that preserve state, history, and context, which are essential for reliable, large-scale deployments.

Microsoft

  • Copilot Checkout and Brand Agents turn shopping conversations into direct purchases. Questions, comparisons, and decisions happen in one place, creating a clear context about why the customer chose the product.
  • These AI agents work where purchase decisions occur—within conversations and product websites—allowing them to guide users and complete checkout without additional steps.
  • Merchants retain control of customer transactions and data. Over time, this engagement creates useful context about customer intent and buying patterns, helping future decisions be faster and more accurate.
